In critical applications such as medical diagnostics, autonomous systems, and finance, artificial intelligence (AI) models must not only provide accurate predictions but also reliably communicate their uncertainty. AI models can sometimes produce convincing but unreliable answers, leading to significant risks if they operate beyond their reliable knowledge, according to researchers at the University of Miami College of Engineering and CISPA. This issue underscores the importance of uncertainty quantification (UQ) in improving the robustness, interpretability, and reliability of machine learning systems.

The selection of an appropriate UQ technique for high-stakes applications involves evaluating trade-offs among methodological approach, computational resources, and the interpretability of uncertainty estimates. While various methods exist to quantify uncertainty, some are computationally expensive, difficult to apply, or require significant modifications to model architecture, as noted by CISPA researcher Soroush Zargarbashi. This article compares three prominent AI uncertainty quantification techniques—Bayesian Neural Networks, Ensemble Methods, and Conformal Prediction—to help in selecting the most suitable method for specific application requirements.
